Machine Learning Based Analysis of Groundwater Nitrate-Nitrogen Using Multiscale Land Cover Variables in the Chungcheong Region, South Korea
본 연구는 충청권 지하수 내 질산성질소(NO3-N) 농도에 영향을 미치는 수화학적 요인과 토지피복 요인을 평가 하였다. 이를 위해 2017년부터 2024년까지 수집된 4,301개 관정의 지하수 수질 자료와 관정 중심 50-300 m 반경의 토 지피복 변수를 결합하여 분석하였다. 지하수 수질 특성은 주성분분석, 탐색적 요인분석, 계층적 군집분석 및 K-means 군집분석을 통해 평가하였으며, CatBoost 모델과 SHAP 분석을 활용하여 질산성질소 예측 성능과 주요 변수의 기여도 를 해석하였다. 분석 결과, 질산성질소, 경도, 염소이온, 황산이온은 인위적 오염과 관련된 주요 수화학 변수로 확인되 었다. 군집분석에서는 지하수 시료가 저농도, 중간 농도, 고농도 군집으로 구분되었으며, 질산성질소 농도가 증가할수록 주요 이온 농도도 함께 증가하는 경향을 보였다. CatBoost 모델은 200 m 버퍼 반경에서 가장 우수한 검증 성능을 보였 고, 300 m 반경에서도 낮은 예측 오차와 유사한 성능을 나타냈다. SHAP 분석 결과, 염소이온과 경도가 가장 영향력 있는 변수로 나타났으며, 농업지역 면적 비율은 질산성질소 농도와 양의 관련성을 보였다. 이러한 결과는 지하수 질산 성질소 오염이 수화학적 특성과 토지피복 요인의 복합적인 영향에 의해 조절되며, 다중 반경 토지피복 변수와 머신러닝 기법이 지하수 수질 평가에 유용하게 활용될 수 있음을 시사한다.
This study investigated the hydrochemical and land cover factors influencing groundwater nitrate-nitrogen (NO3- N) concentrations in the Chungcheong region of South Korea. Groundwater quality data from 4,301 wells collected between 2017 and 2024 were integrated with land cover variables derived from buffer radii ranging from 50 to 300 m. Principal component analysis, exploratory factor analysis, hierarchical cluster analysis, and K-means clustering were used to characterize groundwater quality, whereas a CatBoost model and SHAP analysis were employed to evaluate predictive performance and quantify variable contributions. NO3-N, hardness, chloride, and sulfate were identified as the key hydrochemical variables associated with anthropogenic contamination. Cluster analysis classified the samples into low-, moderate-, and high-concentration groups, with NO3-N concentrations increasing in parallel with major ion concentrations. The CatBoost model achieved the best validation performance at the 200 m buffer radius, whereas the 300 m buffer yielded comparable performance with a low prediction error. SHAP analysis indicated that chloride and hardness were the most influential variables, whereas the proportion of agricultural land was positively associated with NO3-N concentrations. These results suggest that groundwater NO3-N contamination is governed by the combined effects of hydrochemical and land cover factors and that incorporating multiscale land cover variables into machine learning models can support groundwater quality assessments.
