Dual radar sensor-based condition diagnosis of rainwater drains and multi-task learning for urban flood onset prediction
기후변화로 인한 집중호우 빈도 및 강도 증가는 도시 내수 침수 피해를 구조적으로 확대시키고 있다. 특히 도로와 하수관거의 연결부에 설치된 빗물받이는 도로 표면수의 일차적 배수 경로임에도 불구하고, 낙엽⋅담배꽁초⋅토사⋅쓰레기 등의 이물질 누적과 그레이팅 막힘으로 통수능력이 급격히 저하되어 국지적 침수의 직접적 원인이 된다. 그러나 전국 약 900만 개에 달하는 빗물받이 시설(Ministry of Environment, 2023)의 상태를 실시간으로 모니터링하고, 청소 및 유지관리 시점을 과학적으로 결정할 수 있는 정량적 체계는 아직 확립되지 않았다. 본 연구는 이러한 한계를 보완하기 위해 77 GHz 대역 FMCW 레이더 수위 센서를 도로 표면과 빗물받이 내부에 이중 배치하고, 기상청 초단기예보 API로부터 수집한 강수 예보와 실측 수위·침전물 누적 데이터를 결합한 다중과제 학습(Multi-Task Learning) 기반 AI 분석 체계를 제안한다. 본 연구의 핵심 기여는 (i) 이중 레이더 계측 자료에 기반한 빗물받이 상태의 4단계 진단, (ii) 침수 발생 여부와 침수 시점을 동시 예측하는 다중과제 학습 모델 설계, (iii) 빗물받이 단위 stratified split에 의한 데이터 누수 차단 검증, (iv) 임계값 기반 판정과 AI 기반 판정의 학술적 비교에 있다. 서울특별시 성동구 행당동 시범 구역에서 약 11개월간 수집한 2,184만 건의 시계열 데이터를 활용하여 모델을 학습⋅검증한 결과, 침수 발생 예측에서 AUROC 0.943, F1 0.871, 침수 시점(±10분 기준) 예측 정확도 88.7%를 확보하였다. 5-fold 교차검증 기준 표준편차는 F1 0.012, ±10분 정확도 1.8%p로, 모델의 안정성도 함께 확인하였다. SHAP 기반 설명가능성 분석을 통해 직전 1시간 누적 강수량, 빗물받이 내부 수위 변화율, 도로 수위 변화율이 침수 시점 판별의 주요 기여 변수임을 확인하였다. 본 연구의 분석 체계는 기후변화 시나리오 하에서 도시 침수 대응을 수작업 점검 중심에서 데이터 기반 선제적 관리로 전환하는 기술적 기반을 제공한다.
Climate change is increasing the frequency and intensity of localized heavy rainfall, which in turn amplifies the damage caused by urban pluvial flooding. Roadside drains are the primary drainage path for surface runoff, but their discharge capacity quickly degrades due to debris accumulation and grate clogging, directly causing localized inundation. This study proposes a Multi-Task Learning-based AI analysis framework. It utilizes 77 GHz FMCW radar water-level sensors in a dual configuration—on the road surface and inside the drain sump—and integrates precipitation forecasts from the Korea Meteorological Administration with field-measured water level and sediment accumulation data. Key contributions include: (i) a four-state condition diagnosis of rainwater drains based on dual-radar measurements; (ii) a multi-task learning model that jointly predicts flood occurrence and onset time; (iii) data-leakage-free validation achieved through a drain-ID-stratified split; and (iv) an academic comparison between threshold-based and AI-based decisions. Using 21.84 million time-series records collected over 11 months at a pilot site in Haengdang-dong, Seongdong-gu, Seoul, the proposed model achieved an AUROC of 0.943, an F1 score of 0.871, and 88.7% accuracy for flood onset time (±10 min). The 5-fold cross-validation yielded standard deviations of 0.012 for F1 and 1.8%p for ±10-min accuracy.
